Therefore, efficiently and timely acquire this information of potato plant is important for guiding farmland production management. Traditionally, manual actual surveys are time-consuming, laborious and destructive, and fail to meet the modern needs of smart agriculture. With the advancement of science and technology, remote sensing technology has attracted people’s attention for its advantages of non-destructive, high-throughput, and rapid acquisition of phenotype information of ground objects. Compared with satellite, aerial and ground remote sensing, UAV remote sensing technology is widely popularized in precision agriculture monitoring due to its strong mobility, simple operation, low operating cost, and the ability to obtain high-resolution digital orthophotos under the cloud. In this study, the UAV equipped with high-definition digital camera was used to obtain the image data of potato with budding periods, tuber formation period, tuber growth period, starch accumulation period and maturity period, and the height (H) and AGB of potato plant on the ground were measured, and the longitude, dimension and height of Ground Control Points (GCPs) were obtained by Global Positioning System (GPS) from March to July 2019. Firstly, the Digital Surface Model (DSM) was generated by structure from motion algorithm based on the image data of the experimental area and the location information of GCPs, and the Hdsm (potato plant height) of each growth period was extracted based on DSM. Then, combining 26 image indices with better performance in AGB monitoring based on the digital number value of the image, crop height of field survey by ruler (H) and crop height extracted based on DSM difference calculation (Hdsm) into a new data set. The first 7 indices and Hdsm based analyzing the correlation between these parameters (26 vegetation indices, H and Hdsm) and AGB were screened to construct the AGB estimation model of five growth periods. Finally, in order to further increase the variance of the different model, Multiple Linear Regression (MLR), Support Vector Machine (SVM) and Artificial Neural Network (ANN) are selected to build the AGB estimation model based on the sensitivity parameters. Through the quantitative analysis of the model, the optimal estimation model is selected for each growth period to monitor crop conditions. The results showed that: the extracted plant height (Hdsm) is fitted with the measured plant height ( R 2 =0.86, RMSE=6.36cm, NRMSE=13.42%); the AGB estimation model was constructed by three different modeling methods in each growth period, in which the model by integrating with Hdsm into vegetation indices was better; it is found that the effect of MLR model ( R 2 =0.61, 0.74, 0.77, 0.72 and 0.60) with incorporating the Hdsm into image indices in each growth period to estimate AGB is better than that of SVM ( R 2 =0.60, 0.69, 0.73, 0.69 and 0.58) and ANN ( R 2 =0.56, 0.67, 0.71, 0.65 and 0.55). The results of this research help solve the problem of monitoring AGB in the traditional way and provide reference for real-time monitoring of potato growth and yield prediction accurately. 无人机 数码影像 数字表面模型 马铃薯 株高 地上生物量 unmanned aerial vehicle digital image digital surface model potato plant height above-ground biomass 1　引言 1 地上生物量（AGB）是评估作物长势的关键指标，和产量之间有着密不可分的联系，其动态变化能够直接反映出作物的生长情况和营养状况（ Colomina和Molina，2014 Colomina和Molina，2014 ； Yang 等，2017b Yang 等，2017b ）。因此，精准高效地监测AGB，可以及时获悉作物长势状况和预估产量，这对指导农业精细化管理具有重要的作用（ 徐云碧，2015 徐云碧，2015 ）。而传统方法测量AGB需要消耗大量人力、物力和财力，测定过程中往往对作物造成破坏，且作业范围仅局限于小规模，大面积作物AGB的估算难以实施（ Watanabe 等，2017 Watanabe 等，2017 ； Singh 等，2017 Singh 等，2017 ； 阎广建 等，2016 阎广建 等，2016 ； 陈仲新 等，2016 陈仲新 等，2016 ）。 当前，无人机遥感技术凭借应用灵活、操作简单、可获取高时空分辨率影像等优势，在作物AGB监测方面得到广泛关注（ 姚阔 等，2016 姚阔 等，2016 ）。无人机平台可搭载多种传感器（如多光谱、高光谱和激光雷达），但因其传感器价格昂贵，制约了无人机遥感技术的应用（ Candiago等，2015 Candiago等，2015 ； Potgieter等，2017 Potgieter等，2017 ； Yang等，2017a Yang等，2017a ； Yuan等，2017 Yuan等，2017 ； Nie等，2016 Nie等，2016 ； Guo 等，2017 Guo 等，2017 ）。数码相机传感器虽然仅有3个波段，但价格低廉、获取的影像分辨率较高、数据后续处理较为简单等特点，使得能够作为一种性价比高的数据获取方式，已经得到国内外许多学者的关注。 陶惠林等（2019） 陶惠林等（2019） 基于无人机数码影像，利用逐步回归、偏最小二乘和随机森林3种方法结合植被指数估算冬小麦AGB，结果表明逐步回归模型估算精度较高。 张领先等（2019） 张领先等（2019） 基于无人机数码影像，采用偏最小二乘、BP神经网络、支持向量机和随机森林4种方法结合多种植被指数构建冬小麦AGB估算模型，结果表明偏最小二乘法相比其他方法构建的模型效果更优。 崔日鲜等（2015） 崔日鲜等（2015） 基于无人机数码影像，利用BP神经网络和多元线性回归技术结合植被指数估算冬小麦AGB，结果显示神经网络AGB估算模型优于多元线性回归模型。以上成果表明，无人机数码影像能够很好的对作物AGB进行有效监测，但存在一定的不足，仅利用影像的光谱信息构建的植被指数估算AGB，模型精度容易达到饱和现象。针对这一问题，一些学者通过引入与AGB相关的因子，如作物株高，来综合构建模型，提高了作物AGB估算精度。如 Bendig等（2015） Bendig等（2015） 基于无人机数码影像，利用作物表面模型CSM（Crop Surface Model）提取大麦株高，将提取株高与植被指数进行结合估算AGB，结果表明相较于单一植被指数模型，融合指标模型精度更高。 Yue等（2017） Yue等（2017） 通过偏最小二乘和随机森林两种方法，基于CSM提取的作物株高与植被指数进行结合估算冬小麦AGB，结果表明加入株高能够解决模型出现的过早饱和问题。 综上可知，通过不同的方法以不同变量可以较好地估算小麦和大麦等作物的AGB，然而，马铃薯株型结构与上述作物明显不同，其AGB从幼苗期到茎叶生长旺盛的块茎增长期持续上升，而从生长后期的淀粉积累期，地上叶片开始衰落，AGB值总体开始下降，整个生育期AGB值呈现先上升后下降的变化趋势，故已有的研究方法是否适用于马铃薯作物长势监测，还需要进一步验证。目前，耦合无人机数码影像光谱信息和提取的株高信息开展马铃薯AGB估测研究鲜有报道，因此，本研究尝试利用DSM提取出马铃薯植株高度Hdsm，然后通过3种建模方法基于植被指数、植被指数结合Hdsm估算马铃薯AGB，对比分析各模型的适用性和估算能力，寻求最佳估算因子和建模方法，为小区域马铃薯AGB监测提供新的技术手段。 2　材料与方法 1 2.1　试验位置和试验方案 2 马铃薯试验区域位于北京市昌平区小汤山镇国家精准农业研究示范基地（40°10′30″N—40°10′35″N，116°26′35″E—116°26′40″E）。试验小区为完全随机试验设计，采用2个马铃薯品种（中薯5和中薯3），3种不同条件的处理（密度、氮素和钾肥），每种条件处理重复3次，总计48个小区，各小区面积为32.5 m 2 。3种密度处理（T1、T2和T3）、4种施氮处理（N0、N1、N2和N3）和3种钾肥处理（K0、K1和K2）具体详情分别见文献（ 刘杨 等，2021 刘杨 等，2021 ），其中种植密度和氮素试验区均为K1处理。试验小区周围均匀布控11个地面控制点，通过GPS获取其三维空间位置信息用来准确生成马铃薯实验田的DSM，具体的试验方案见 图1 图1 所示。 1,2;3; 2.2　地面数据获取 2 1028.97 344.62 33.49 2.3　无人机影像数据获取及预处理 2 试验利用八旋翼电动无人机（单臂长386 mm，机身净重4.2 kg，最大载物重量6 kg，续航时间15—20 min）为遥感平台，分别获取裸土期（2019-04-20）至成熟期的高清数码影像。无人机搭载的高清数码相机型号为Cyber-shot DSC-QX100，其主要参数为：尺寸为62.5 mm×62.5 mm×55.5 mm，质量179 g，2090万像素CMO传感器，焦距10 mm（定焦拍摄）。选择晴朗无云的天气进行遥感作业，此时太阳光照强度稳定。无人机的飞行高度为20 m，航向和旁向重叠率均为85%，影像分辨率约为0.85 cm。 影像获取后需要预处理，主要包括影像对齐、几何校正、生成密集点云、建立格网和空间纹理。影像拼接前，首先对无人机采集的数码影像进行筛选，去除姿态角异常，成像存在问题的影像。具体操作为：将挑选出的带有经纬度、高度、偏航角、俯仰角和旋转角共6种POS信息的每张数码影像和11个GCPs的三维坐标信息导入到Agisoft PhotoScan Professional软件中，还原影像拍摄时的姿态和空间位置并初步对齐照片；通过实测的GCPs位置信息重新优化照片对齐，完成影像的地形校正；基于具有精确空间位置属性的稀疏点云生成飞行区域的高密集点云；在建立密集点云的基础上，生成空间格网并建立纹理信息；生成马铃薯试验田的数字正射影像DOM（Digital Orthophoto Map）和数字表面模型DSM（Digital Surface Model）。其中，块茎增长期的DOM和DSM如 图2 图2 所示。 1,2; 2.4　植被指数的选取 2 植被指数是通过不同波段组合的方式，用来增强植被信息的指示因子（ 陶惠林 等，2019 陶惠林 等，2019 ）。基于马铃薯试验田的DOM，通过研究小区的矢量数据利用ArcGIS软件，提取出各小区马铃薯冠层红、绿、蓝波段的平均DN（Digital Number）值，将红、绿、蓝波段的DN值进行归一化处理，处理前3个波段的植被指数定义为R、G、B，处理后得到的植被指数定义为 r 、 g 、 b 。计算公示如下： <math display="block" id="M1"><mi>r</mi><mo>=</mo><mi mathvariant="normal">R</mi><mo>/</mo><mo GLA=（2G-B-R）/（2G+B+R） Chianucci等（2016） 2.5　数据分析方法 2 马铃薯株高的提取，将基于运动结构算法生成的各生育期DSM分别与裸土期DSM作差值运算，得到马铃薯作物高度模型，最终通过ROI工具利用ArcGIS软件基于各小区的矢量数据，分别计算统计出5个生育期各小区的马铃薯Hdsm。 估算马铃薯各生育期AGB时，所选用的方法为MLR、SVM和ANN。MLR是回归建模过程中最为常用的方法，其能够利用两个及多个变量来解释因变量的变化，相比于只用一个自变量进行估计更有效。SVM是一类按监督学习方式对数据进行二元分类的广义线性分类器，主要分为线性和非线性向量机，通过核函数对训练数据集进行二元分类，使所有样本离超平面距离最小，从而拟合样本数据，达到预测目的。ANN是对脑神经元网络进行抽象信息化处理的一种运算模型，主要由输入层、隐藏层和输出层构成，通过不断地训练和学习输入的数据集来确定权值，最终选择传递函数对期望的结果进行输出。 本研究对各生育期选取32个样本数据（重复1和重复2）作为建模集来构建AGB估算模型，剩余16个样本数据（重复3）来验证模型效果。为了评估模型预测结果的可靠性，选用决定系数 R 2 （coefficient of determination）、均 方 根 误 差RMSE（Root Mean Square Error）和标准均方根误差NRMSE（Normalized Root Mean Square Error）作为精度评价指标。 3　结果与分析 1 3.1　马铃薯株高的监测 2 将马铃薯5个生育期提取的240个平均Hdsm与对应的实测H数据作拟合分析，结果如 图3 图3 所示。由图可知，基于DSM提取的马铃薯株高Hdsm和实测株高H拟合的 R 2 达到了0.86，NRMSE为13.42%，说明结合GCPs基于DSM提取的株高方法可行。 3.2　马铃薯AGB估算 2 3.2.1　相关性分析 3 将马铃薯5个时期的植被指数、H和Hdsm分别与马铃薯AGB作相关性分析，其结果见 表3 表3 所示。由 表3 表3 可知，相比不同生育期，现蕾期，除WI指数表现不相关外，其余植被指数均与AGB呈现显著相关，其中 g 、 b 、 g / b 、 r + b 、 g - b 、EXG、RGBVI、CIVE、GLA等9个指数的相关性较高，相关系数绝对值均达0.7以上，而g/b相关系数绝对值最大，为0.729；块茎形成期，除 G 、 r / b 、 r - b 、（ r - b ）/（ r + b ）、WI指数表现不相关外，其余植被指数均与AGB呈现显著相关，其中 r 、 g 、 g / r 、 r + b 、（ r - g - b ）/（ r + g ）、EXG、GRVI、MGRVI、EXR、NDI、VARI、EXGR、CIVE13个指数的相关性较高，相关系数绝对值均达0.7以上，而 r 指数相关系数绝对值最大，为0.796；块茎增长期，除G、WI指数表现不相关外，其余植被指数均与AGB呈现显著相关，其中 g / r 、GRVI、MGRVI、EXR、NDI、VARI、EXGR7个指数的相关性较高，相关系数绝对值均达0.7以上，而EXR指数相关系数绝对值最大，为0.723；淀粉积累期和成熟期，除了个别指数不相关外，其余指数均达到显著水平，而淀粉积累期B指数相关性最高，相关系数绝对值为0.739；成熟期WI指数相关性最高，相关系数绝对值为0.547，但相较前4个生育期而言，植被指数与AGB相关性系数绝对值普遍较低。5个生育的H和Hdsm均与AGB达到极显著相关，相关性均在块茎增长期达到最高，其中Hdsm与AGB的相关性要高于H。 0.684** 0.601** 0.482** 3.2.2　马铃薯AGB估算精度分析和验证 3 根据植被指数与AGB相关性分析结果，将相关系数绝对值按从大到小依次排列，在不同生育期分别挑选前7个相关性较高的植被指数与Hdsm一起作为自变量利用MLR、SVM、ANN共3种方法来构建各生育期的AGB估算模型，并验证模型精度，其结果见 表4 表4 和 表5 表5 。根据 表4 表4 和5可知，每个生育期将株高Hdsm与植被指数共同作为自变量利用MLR、SVM和ANN方法构建AGB估算模型时，建模和验证的模型精度均高于相应的以植被指数所构建的。每种方法得到的AGB估算模型，建模集和验证集均从现蕾期到块茎增长期这3个生育期AGB估算效果逐渐变好， R 2 不断增大，RMSE和NRMSE逐渐减小，从淀粉积累期到成熟期 R 2 逐渐减小，RMSE和NRMSE逐渐增大，估算效果开始变差。使用3种回归方法分别以不同变量估算AGB时，均在块茎增长期达到最高的估算精度。各生育期估算AGB时，通过MLR以植被指数和株高Hdsm建模 R 2 分别为0.61、0.74、0.77、0.72和0.60；RMSE分别为203.39 kg/hm 2 、204.32 kg/hm 2 、121.48 kg/hm 2 、207.36 kg/hm 2 和217.36 kg/hm 2 ；NRMSE分别为16.73%、15.88%、11.58%、16.19%和17.59%。SVM建模 R 2 分别为0.60、0.69、0.73、0.69和0.58；RMSE分别为211.14 kg/hm 2 、206.56 kg/hm 2 、128.51 kg/hm 2 、215.53 kg/hm 2 和235.53 kg/hm 2 ；NRMSE分别为18.01%、16.41%、12.68%、17.58%和18.34%。ANN建模 R 2 分别为0.56、0.67、0.71、0.65和0.55；RMSE分别为240.68 kg/hm 2 、216.77 kg/hm 2 、128.66 kg/hm 2 、233.25 kg/hm 2 和258.45 kg/hm 2 ；NRMSE分别为19.17%、17.66%、12.74%、17.98%和19.96%。3种方法构建的AGB验证模型 R 2 与建模集 R 2 接近，且RMSE和NRMSE较低，说明3种方法在每个生育期构建的AGB模型拟合效果较好，模型较为稳定。综合以上可知，MLR-AGB估算模型效果最优，其次为SVM-AGB模型，而ANN-AGB模型效果最差。 2 生育期 2 变量 3 MLR 3 SVM 3 中可以看出，现蕾期，马铃薯刚刚开始生长，因此其AGB值最小；块茎形成期，地上部茎叶与地下部块茎同时生长，马铃薯AGB值变大，且最大值分布主要集中在试验田的中部；块茎增长期，茎叶生长迅速，光合作用强，有机物较快积累，块茎变得膨大，是马铃薯各生育期中生长最旺盛的时期，其AGB最大值空间分布同比其他时期较大；淀粉积累期，马铃薯前期积累的营养物质需要向地下块茎转移，造成地上器官营养缺乏，外受到雨季气候的影响，植株茎叶迅速枯萎脱落，AGB最大值分布趋势明显逊与前一期；成熟期，马铃薯试验田东边小区地上茎叶基本完全枯黄，AGB值较西边小区低，这与马铃薯的营养状况、小区施肥追肥管理有关。通过AGB空间分布图可以直接看出马铃薯整个生育期的长势变化情况，这为实际的田间决策管理提供了有力帮助。 1,2,3;4,5,6; 3.3　讨论 2 3.3.1　株高监测 3 本文基于无人机高清数码影像结合GCPs生成了马铃薯试验田的DSM，从而提取出了不同生育期的株高Hdsm，与地面实测株高H拟合的 R 2 为0.86，说明了提取的Hdsm效果较优，所得结果与他人通过无人机高清数码影像提取作物高度结果基本一致（ 牛庆林 等，2018 牛庆林 等，2018 ）。然而，本研究提取的马铃薯Hdsm相比于实测株高H整体偏小，这是因为数码相机传感器获取的是马铃薯植株冠层影像数据，而地面实测株高为最高点，从影像提取株高时被当作噪声去除，所以基于运动结构算法提取的Hdsm较小。另外，无人机拍摄的数码影像中包含一部分裸土像元，在提取马铃薯株高时，也参与了运算，这同样会使提取的株高值偏低。 3.3.2　AGB估算 3 本文首先将各生育期的植被指数与马铃薯AGB进行相关性分析，经比较发现，成熟期的植被指数与AGB的相关系数绝对值最低，主要因为生育后期地上茎叶积累的有机物需要向地下块茎输送，造成地上茎叶营养匮乏，导致叶片枯黄脱落，植被覆盖度在整个生育期中最低，从而进行马铃薯冠层光谱信息提取时，容易受到地面土壤背景的干扰，使得组建的植被指数未能充分表达与AGB的关系。每个生育期利用MLR、SVM、ANN以植被指数、植被指数加Hdsm为变量构建的估算模型和验证模型的 R 2 都较高，RMSE也都较小，说明拟合效果极好，建模的稳定性较强，能够很好地对AGB进行估测。每个生育期利用3种方法均在块茎增长期达到最佳估算效果，主要因为马铃薯刚开始为了维持自身的生命体征，茎节伸长和叶片扩大，到了块茎增长期，马铃薯地上各生长部位已发育完善，此时植被覆盖度属于整个生育期最优时期，而生育期后期由于地下块茎的膨大，地上积累的营养物质需要不断向地下转移，造成地上茎叶枯萎凋零，植被覆盖度逐渐降低，导致马铃薯整个生育期的冠层光谱信息与AGB关联度由强到弱。但是，每个生育期通过MLR构建的估算模型精度和验证模型稳定性都要高于相应的SVM和ANN的，主要原因：（1）SVM和ANN都能够高效处理较大数据集，对于具有非线性特征的较小数据集，SVM较ANN泛化能力较优一些，但本研究的小数据集仍存在一定共线性，2种方法均对共线性敏感，所以SVM和ANN的表现能力较差一些。（2）SVM在拟合过程中受到了和函数和惩罚因子的限制，降低了AGB估算精度，而ANN在训练过程中反复地学习细节，造成估算能力欠佳。通过对马铃薯5个主要生育期的AGB估算模型进行分析可知，每个生育期植被指数加入株高Hdsm能够提高模型精度，这与 陶惠林等（2019） 陶惠林等（2019） 研究具有一致的结论，都表明融入株高数据能够较好的估算AGB，而本文构建的单生育期AGB估算模型精度较好，主要因为本文利用GCPs优化影像对齐，降低了提取株高和光谱信息的误差。从AGB空间分布图中可以看出，马铃薯整个生育期的AGB呈现先升高后降低的变化趋势，且同生长期不同小区AGB值也存在明显差异，主要因为马铃薯生长过程中，AGB前期以茎叶为主，后期以地下块茎为主，由于施肥追肥等处理方式不同，导致同生育期各小区AGB值差异也较大。本研究仅用1 a的无人机数码影像估算马铃薯AGB，还需要更多时期和多个地方的马铃薯数据对模型的适用性和外推性进行验证，以便实现作物长势的实时动态监测。 4　结论 1 本文针对作物生长后期由于光谱饱和现象造成的AGB低估问题，提出了利用DSM提取作物结构信息结合冠层光谱信息估算AGB的新思路。该思路通过3种建模方法均证实了马铃薯株高数据对提升AGB估算模型精度的可靠性和稳定性，但是本文对各生育期AGB估算模型参数个数具有一定主观性，今后的研究中考虑基于赤池信息量准则确定最佳模型参数个数。 本文通过无人机数码影像基于植被指数、植被指数和作物高度的融合利用MLR、SVM和ANN方法估算马铃薯AGB，得出以下主要结论： （1）基于无人机高清数码影像结合GCP生成试验田的DSM，基于DSM提取的株高Hdsm与实测株高H具有高度的拟合性（ R 2 =0.86，RMSE=6.36 cm，NRMSE=13.42%），说明利用DSM提取的马铃薯株高的方法可行，对田间马铃薯株高估算的精度很高，可为大面积的田间马铃薯株高测量提供一种新的技术手段。 （2）选取了MLR、SVM、ANN共3种回归方法，分别构建马铃薯5个生育期的AGB估算模型。最终得知，加入Hdsm能够提高每种方法所构建的模型效果，其中加入Hdsm的MLR方法估算AGB效果最好， R 2 分别为0.61、0.74、0.77、0.72和0.60；RMSE分别为203.39 kg/hm 2 、204.32 kg/hm 2 、121.48 kg/hm 2 、207.36 kg/hm 2 和217.36 kg/hm 2 ；NRMSE分别为16.73%、15.88%、11.58%、16.19%和17.59%。
