The advanced hyperspectral imager (AHSI) onboard GF-5 is a sensor that can acquire data covering visible, near-infrared (VNIR) and short-wave infrared (SWIR) wavelengths with very fine spectral resolution (i.e., 5 nm for VNIR and 10 nm for SWIR). The spatial resolution of GF-5 AHSI data (i.e., 30 m), however, is relatively coarse for extraction of land cover information in a number of cases, such as small-sized buildings and roads in urban areas.Objective To produce GF-5 data with both fine spatial resolution and spectral resolution, in this paper, GF-5 hyperspectral images were downscaled to 10 m by spatial-spectral image fusion with 10 m Sentinel-2 multispectral images. To deal with the great challenges in the large computational burden of the advanced information loss guided image fusion (ILGIF) method and the ubiquitous effect of the point spread function (PSF), this paper also aims to introduce a fast and accurate method for downscaling GF-5 data.Method A fast ILGIF (FILGIF) method is proposed. Specifically, the original GF-5 hyperspectral data are transformed to a new feature space by principal component analysis (PCA), and the ILGIF-based spatial-spectral image fusion is implemented for the first few principal components. The fused components coupled with remaining ones are transformed back to the original space to produce the 10 m downscaled results. Moreover, the scale transformation optimal PSF between 10 m Sentinel-2 and 30 m GF-5 data was estimated adaptively for each band of GF-5 to enhance downscaling.Result Experimental results showed that by fusing with the 10 m Sentinel-2 data, the 30 m GF-5 hyperspectral data can be downscaled effectively to 10 m. The FILGIF and ILGLF methods produced greater accuracy than the area-to-point regression kriging (ATPRK) and approximate ATPRK (AATPRK) methods. Moreover, compared to ILGIF, the computational cost of the fast version (i.e., FILGIF) was reduced significantly (by more than 30 times). In addition, by considering the PSF effect adaptively for each band, the accuracy of downscaling results was increased.Conclusion The Sentinel-2 images are suitable for downscaling GF-5 hyperspectral images. The proposed FILGIF method can produce comparable accuracy compared to ILGIF while the computational cost is decreased significantly. spatial-spectral image fusion geostatistics point spread function (PSF) 1　引 言 1 近年来，随着遥感技术的发展，遥感对地观测呈现多平台、多角度、多层次的发展态势（ 李树涛等，2021 李树涛等，2021 ）。我国发射的高分五号（GF-5）是世界首颗实现对大气和陆地综合观测的全谱段高光谱卫星，其发射具有重要意义。GF-5拥有6个载荷，其中搭载的AHSI相机可以获取60 km幅宽、30 m空间分辨率和330个光谱波段（包括150个VNIR和180个SWIR波段）的高光谱影像，且能够全球周期性覆盖。尽管GF-5 AHSI数据光谱分辨率较高，但其30 m空间分辨率难以满足局部区域精细特征提取的需求，如城市地物分类、矿物识别、植被分类等（ 袁静文等，2020 袁静文等，2020 ）。为充分发挥GF-5数据原有高光谱分辨率优势，并进一步提高其描述空间细节能力，更好地服务于各种应用场景，有必要研究提高其空间分辨率的降尺度方法（ Atkinson， 2013 Atkinson， 2013 ）。 降尺度技术可直接应用于30 m的GF-5高光谱数据，即其实现可以不需借助任何辅助数据。然而，降尺度是一病态逆问题，通常存在较大的不确定性，尤其是在地表覆盖的空间异质性较强和放大比例较大时更为突出。空谱融合通过融合同一区域下不同空间和光谱分辨率（即高光谱分辨率但低空间分辨率，以及高空间分辨率但低光谱分辨率）的数据，得到兼具高空间和高光谱分辨率的图像，可以解决光学传感器空间分辨率和光谱分辨率之间无法兼顾的矛盾，已成为实现降尺度的有效方法（张良培和沈焕峰，2016； 肖亮等，2020 肖亮等，2020 ）。但是，由于GF-5数据自身搭载的传感器无法获取更高空间分辨率的遥感图像，因此可考虑借助其他卫星的高空间分辨率图像实现GF-5的降尺度。哨兵二号（Sentinel-2）系列卫星由欧空局分别于2015年和2017年发射的Sentinel-2A和-2B两颗卫星组成，是哨兵系列卫星中的高空间分辨率多光谱成像卫星（ Wang等，2016a Wang等，2016a ），其通过MSI传感器提供13个通道（包括4个10 m、6个20 m和3个60 m空间分辨率波段）下的多光谱数据。本文考虑融合Sentinel-2的10 m多光谱（覆盖可见光和近红外光谱区间）数据，将GF-5的VNIR高光谱数据降尺度至10 m。利用Sentinel-2数据进行空谱融合的主要优势如下。其一，空间上，Sentinel-2数据同样可以实现全球覆盖，这意味着GF-5和Sentinel-2对全球任一区域均存在观测数据，即二者的空谱融合在理论上可对任一区域进行。其二，时间上，Sentinel-2A和-2B卫星的联合观测能将重返周期缩短至5天，更易得到与GF-5数据同时间、同区域的多光谱数据。其三，光谱上，Sentinel-2 Ghamisi等，2019 Ghamisi等，2019 ； Aiazzi等，2007 Aiazzi等，2007 ）。代表性方法有亮度-色调-饱和度变换法（intensity-hue-saturation， IHS） （ Carper等，1990 Carper等，1990 ； Chavez等，1991 Chavez等，1991 ； Huang等，2007 Huang等，2007 ）、主成分分析法（principal component analysis， PCA） （ Shah等，2008 Shah等，2008 ）和基于小波变换的融合方法（ Amolins等，2007 Amolins等，2007 ）等。第二类方法是基于学习的融合方法，其核心是利用已知高和低分辨率数据对构建二者的非线性映射关系。早期方法包括如稀疏表示等在内的机器学习方法。近几年随着深度学习的发展，越来越多的学者关注其在空谱融合中的应用（ Yang等，2018 Yang等，2018 ； Song等，2018 Song等，2018 ； Shen等，2020 Shen等，2020 ； Wang等，2020a Wang等，2020a ）。第三类方法是地统计学法。该方法能顾及数据在空间支撑上的变化以及传感器点扩散函数（point spread function， PSF）效应（ Atkinson等，2008 Atkinson等，2008 ）。该类方法最重要的优势在于，其降尺度结果与原始低空间分辨率数据具有完整的一致性。代表方法有面到点回归克里格法（area-to-point regression kriging， ATPRK） （ Wang等，2016b Wang等，2016b ）、ATPRK的快速模型（approximate area-to-point regression kriging， AATPRK） （ Wang 等，2017 Wang 等，2017 ）和基于信息损失的融合方法（information loss-guided image fusion， ILGIF） （ Wang等，2020a Wang等，2020a ）。 ILGIF是一种基于面到点克里格（area-to-point kriging， ATPK）插值以及信息损失（information loss， IL）估计的融合算法。不同于ATPRK，ILGIF通过地理加权回归（GWR）模型（ Foody等，2003 Foody等，2003 ； Brunsdon等，1996 Brunsdon等，1996 ）考虑地物覆盖的空间变异性，进而更准确地估计高空间分辨率下的信息损失。然而，ILGIF方法对每个波段单独处理，在ATPK模块中的各类半方差函数的估计以及克里格方程的求解使得运算效率整体偏低，尤其是在处理高光谱数据时，大量波段将明显限制ILGIF方法的运算效率。因此，需要发展更为高效的方法实现空谱融合。另一方面，在空谱融合过程中，尺度转换PSF通常未知，且在各个低空间分辨率波段下并不一致（ Wang等，2020b Wang等，2020b ），需要利用有效的PSF估计方法实现GF-5高光谱数据的降尺度。综上所述，GF-5高光谱数据的降尺度研究对推动国产高光谱数据的研究与应用具有重要意义。本文利用Sentinel-2数据，通过发展空谱融合方法对该问题展开研究。 2　研究方法 1 2.1　ILGIF 2 ILGIF方法（ Wang等，2020a Wang等，2020a ）主要包括基于ATPK的降尺度预测和降尺度过程的信息损失估计。降尺度本质上为一个逆向不适定的问题，在对原始低空间分辨率图像（例如GF-5高光谱数据）利用ATPK进行降尺度时，高空间分辨率下的信息往往无法全部恢复，即ATPK结果会存在一定的信息损失。理想的降尺度结果和原始数据之间存在如下关系： <math display="block" id="M1"><mi 的信息增益（information gain）， IL 表示降尺度结果的信息损失。因此，为了得到与理想结果更加接近的降尺度结果，需要估计ATPK在降尺度过程中出现的信息损失 IL 。在基于ILGIF的空谱融合方法中， IL 通过参考高空间分辨率波段数据的降尺度过程而获得。 ILGIF方法能顾及PSF效应以及地物覆盖的空间变异性，其降尺度结果与原始低空间分辨率数据具有完整的一致性，是一种高精度的空谱融合方法（ Wang等，2020a Wang等，2020a ）。不足的是，该方法耗时较长。具体地，该方法对每个低空间分辨率波段依次处理，由于ATPK运算效率偏低（尚可处理波段数较少的多光谱数据），在处理波段数非常多的高光谱数据时，运算时间较长。 2.2　FILGIF 2 为克服ILGIF在处理GF-5高光谱数据时运算效率偏低的问题，本文提出了更为高效的FILGIF算法，其流程如 图1 图1 所示。FILGIF首先对30 m GF-5数据 <math id="M2"><msubsup><mrow><mi 对GF-5数据所有波段依次进行上述操作，获得各自的最优PSF估计。 可以看到，本文采用的PSF估计方法适用于融合多个细分辨率波段的情形，可以对每个波段单独估计，无需假设它们的PSF一致，且无需借助其他数据，具有较好的应用能力。 3　实验结果 1 3.1　实验设计和数据 2 为验证融合Sentinel-2数据进行GF-5高光谱数据降尺度的可行性，提出的FILGIF方法的有效性，以及尺度转换PSF准确估计的重要性，本文设计了三组实验。实验一通过模拟数据验证FILGIF方法的有效性。具体地，本文将原始30 m GF-5高光谱和10 m Sentinel-2数据利用相同的点扩展函数模型（即高斯模型，卷积核参数为0.5原始像元）分别退化至90 m和30 m，对90 m GF-5高光谱和30 m Sentinel-2数据进行融合，得到30 m GF-5高光谱数据的估计，并参照原始30 m GF-5高光谱数据进行客观评价。在实验二中，估计了30 m GF-5高光谱和10 m Sentinel-2数据之间的尺度转换PSF，并验证了考虑PSF的重要性。实验三通过融合真实30 m GF-5高光谱和10 m Sentinel-2数据，得到10 m分辨率 GF-5数据，揭示对30 m GF-5高光谱数据降尺度的意义以及融合10 m Sentinel-2数据的可行性。 实验中用到的数据集为同一天（2019年5月24日）获取的同一区域的GF-5数据和Sentinel-2数据。覆盖区域为上海城区，主要地物有道路、城市建筑、植被以及裸地等。具体地，10 m空间分辨率的Sentinel-2影像大小为1350×1350像素，光谱波段4个，由RGB和NIR（近红外）波段组成。30 m空间分辨率的GF-5高光谱数据影像大小为450×450像素，包含150个可见光和近红外波段。实验中数据的处理以及算法由MATLAB R2020a编译实现，在WIN10环境下运行。计算平台配置为Intel（R） Core（TM） i7-10750H CPU @ 2.60GHz。 1,2; 3.2　实验结果与分析 2 3.2.1　30 m空间分辨率模拟图像融合结果 3 如果直接利用原始30 m GF-5数据以及10 m Sentinel-2数据，通过融合算法生成10 m结果，因缺少相应的10 m GF-5参考图像，无法定量评价降尺度结果。因此，在此组实验中，采用了现有文献中常用的策略：将原始30 m GF-5高光谱和10 m Sentinel-2数据分别退化至90 m和30 m，然后对二者进行融合，得到30 m GF-5高光谱数据，而原始30 m GF-5高光谱数据则用于客观评价融合即降尺度的精度。 我们共测试了四种空谱融合方法：ATPRK、AATPRK、ILGIF以及FILGIF。鉴于在之前的研究中，我们已通过一系列实验验证了ATPRK、AATPRK和ILGIF相较于现有主流方法（如信息注入法）在精度上的优势，本文不再系统与这些方法进行对比。对结果采用光谱角映射（spectral angle mapper， SAM）、相关系数（correlation coefficient， CC）、均方根误差（root mean square error， RMSE）、通用图像质量指标（universal image quality index， UIQI） （ Wang和Bovik， 2002 Wang和Bovik， 2002 ）以及相对全局综合误差（relative global-dimensional synthesis error， ERGAS）五项质量指标进行定量评价。SAM先以像元为单位逐个计算，最后将所有像元的指标平均，其比较结果和参考数据之间在光谱上的相似性。为分析主成分数量的影响，我们比较了不同主成分数量下FILGIF算法的运算时间和精度，结果如 图3 图3 所示。可以看到，随着主成分数量的增加，运算时间呈线性增加趋势，但在主成分数量达到4后，算法精度趋于稳定。因此，本文选定的主成分数量为4。 表2 表2 展示了四种融合方法在各项指标下的精度以及运行时间。 图4 图4 展示了四种方法在各个波段下的CC和UIQI指标。从定量评价结果中可以得出三个主要结论。其一，ILGIF与FILGIF方法的融合结果精度相较于ATPRK和AATPRK更高（CC和UIQI均高出0.01以上，ERGAS下降0.33以上，RMSE分别下降0.0020和0.0100，光谱评价指标SAM均下降0.0001和0.0004）。其二，FILGIF与ILGIF方法精度非常接近。尽管前者的RMSE值更大，但仅高出后者8.7%。其三，FILGIF的运算效率是ILGIF方法的近30倍。因此，提出的FILGIF方法在保证了精度的同时，有着更高的运行效率。此外，随着波长变化，精度也随之波动。其原因在于高光谱数据和多光谱数据的波长不完全重叠。例如，Sentinel-2的绿波段和蓝波段间，即578-650nm范围内无数据覆盖。对于此区间内的高光谱数据的降尺度，其精度会偏低。相反地，当高光谱数据和多光谱数据的光谱区间一致时（如完全被Sentinel-2的4个波段覆盖的区间），可以获得更高的融合精度。 的大小会明显影响图像质量。利用各波段估计出的最优 <math id="M87"><mi>σ</mi></math> http://html.publish.founderss.cn/rc-pub/api/common/picture?pictureId=22595762&type= http://html.publish.founderss.cn/rc-pub/api/common/picture?pictureId=22595761&type= 2.45533323 2.62466669 下的PSF可以获得更佳的图像质量（见图中子区域中的黄色标记区域），充分表明了PSF的准确估计在降尺度中的重要性。 3.2.3　10 m空间分辨率GF-5数据的降尺度结果 3 基于实验一和实验二得出的结论，本组实验采用ILGIF和FILGIF方法融合10 m Sentinel-2数据和30 m GF-5，并利用 Wang等（2020b） Wang等（2020b） 中的方法估计PSF，生成10 m GF-5降尺度结果。在运算效率方面，ILGIF和FILGIF方法运行时间分别为2617.2秒和59.8秒，FILGIF方法的运算效率高出40多倍。 图10 图10 和11为不同波段组合下伪彩色显示的10 m融合结果，可以看出10 m融合图像相较于原始30 m GF-5图像空间细节明显增加（如小型建筑物和道路的纹理在10 m结果中更加清晰），且ILGIF和FILGIF方法的结果非常接近。 为验证融合后的10 m GF-5高光谱的应用潜力，我们基于10 m Sentinel-2多光谱数据和10 m GF-5 高光谱数据进行了地物覆盖制图的实验。具体地，我们采用支持向量机的方法，对同一成像时间（2019年5月24日）的Sentinel-2的四个10 m波段数据（红、绿、蓝以及近红外波段）和10 m GF-5的150个VNIR波段数据选取同一子区域（176×137像元，如 图12 图12 （a）所示）进行监督分类。通过Google地图对该区域地物进行目视解译并制作标签，将地物分为水泥面、草地和农用地3类。分类结果和精度统计分布如 图12 图12 和 表3 表3 所示。可以看到，与Sentinel-2多光谱数据的分类结果相比，10 m GF-5数据的地物分类结果更加准确，总体精度和Kappa系数分别高出了2.75%和0.0421。实验结果证明，FILGIF算法生成的10 Sentinel-2数据因具有全球覆盖、时间分辨率高、易获取以及高质量等特点，可以很好地用于GF-5数据的降尺度。但是，利用Sentinel-2数据进行融合也存在一定的不确定性。 在光谱上，可以认为，如果Sentinel-2多光谱数据与高光谱数据的波段范围不匹配，会引起较大的融合误差，尤其是对于未能被Sentinel-2数据光谱区间所覆盖的高光谱波段。所以在利用Sentinel-2数据与高光谱数据进行融合前，应考虑波段之间的光谱重叠。如 表1 表1 所示，为减少因光谱区间不一致而造成的融合结果的不确定性，本文在采用Sentinel-2 MSI数据的4个10 m波段时，只对GF-5 AHSI 的VNIR数据进行了降尺度。这是由于GF-5 AHSI 的SWIR数据的光谱区间不能被10 m Sentinel-2数据所覆盖。 在空间上，在利用Sentinel-2数据时，要充分考虑其和GF-5数据之间的几何匹配程度。在时间上，要尽量保证其和GF-5数据的观测时间一致。在实际情况中，受诸多因素（如过境时间、云雨遮挡等）影响，有时候较难获取同一区域下时间完全相同的Sentinel-2和GF-5数据，二者之间甚至可能会出现较为明显的地物覆盖变化（尤其是在时间间隔较大时），这也是造成Sentinel-2数据的利用具有不确定性的主要原因。 4.2　FILGIF方法的优势 2 本文提出的FILGIF方法不仅适用于GF-5高光谱数据的降尺度，也同样适用于其他高光谱数据和多光谱数据的融合。 Wang等（2016b） Wang等（2016b） 研究表明：与基于成分替换或多分辨率分析法的13种经典融合方法相比，ATPRK可以获得更高精度的融合结果。本文中提出的FILGIF方法很好地继承了ILGIF方法顾及地物覆盖的空间变异性的优点，在实验中的精度也进一步高出现有的高精度的ATPRK方法。另一方面，与成分替换和多分辨率分析等传统方法相比，FILGIF通过解析方法考虑了降尺度过程中的尺度转换PSF，降尺度结果和原始低空间分辨率数据具有一致性，这是现有方法几乎未能做到的。参数方面，作为主要影响因素，主成分数目的确定与所用到的高光谱数据有关。若高光谱数据各波段之间的关联性较低，则可能需要的主成分更多。另一方面，主成分的数量也一定程度影响融合结果的精度。主成分在包含绝大部分信息的同时，也不可避免地丢失了少量的信息，会增加融合结果的不确定性。FILGIF方法结合GF-5数据和Sentinel-2数据的特点，综合考虑了算法效率和精度，提取四个主成分，在保证ILGIF融合精度的前提下，极大地提高了算法效率。 4.3　10 m GF-5数据应用前景 2 与30 m GF-5数据相比，10 m GF-5数据具有显而易见的优势。一方面，在光谱信息表达层面上，后者完全继承了前者极高光谱分辨率的优势，是传统的多光谱传感器的光谱分辨率的几十倍，可以获取地表覆盖更为详细的光谱特性。另一方面，在空间信息表达层面上，10 m GF-5数据具有更广阔的应用前景。例如在农业区域，一些小型农田的尺寸小于30 m，在30 m空间分辨率的GF-5数据中多数表现为混合像元，作物类别难以判定，而10 m空间分辨率下的GF-5数据可以对小于30 m的小型农田进行更有效的区分。城市地区具有更加复杂的地物覆盖，在30 m空间分辨率下城市的空间纹理细节不能很好地表达，例如大型建筑物（如体育馆，地标建筑）的边界模糊，小型建筑物和不透水面难以识别等，而在10 m GF-5数据下，这些地物的纹理可以得到识别，提高分类和提取的精度。基于FILGIF方法的高空间分辨率高光谱数据生成的另一优势是运行效率方面的显著提升。未来可基于稳定获取的高光谱数据，快速生成大范围下的融合数据，实现对地表覆盖快速且精细的监测，为相关部门提供数据支撑。 5　结 论 1 GF-5是为数不多的国产高光谱卫星，研究其高光谱数据的降尺度具有重要意义。与此同时，多光谱和高光谱数据融合技术也不断发展成为遥感数据融合方向的热点。本文基于Sentinel-2数据全球覆盖、时间分辨率高、易获取以及质量高等优势，通过融合10 m Sentinel-2多光谱数据，将30 m GF-5高光谱数据降尺度至10 m。具体地，基于现有先进的ILGIF方法，提出了一种快速的FILGIF方法。同时，采用了一种简单方法估计PSF，考虑30 m GF-5高光谱数据各个波段和10 m Sentinel-2数据之间的尺度转换PSF。本文的主要贡献和结论如下： （1） 通过融合Sentinel-2数据，能有效实现30 m GF-5的降尺度，生成可靠的10 m高空间分辨率的高光谱数据。 （2） 针对现有先进的ILGIF方法在高光谱数据处理上运算效率低的问题，提出了FILGIF方法，该方法在最大程度保证融合精度的前提下，极大提升了计算效率。 （3） 尺度转换PSF在降尺度过程中有着重要影响。基于 Wang等（2020b） Wang等（2020b） 中的方法，可以获得GF-5高光谱各个波段和10 m Sentinel-2数据之间的尺度转换PSF的准确估计，对应的融合结果质量更佳。
